Time-series forecasting is traditionally treated as a deterministic regression problem, minimizing Mean Squared Error (MSE). While this yields accurate average predictions, it often fails to capture the high-frequency dynamics and stochastic nature of real-world data, resulting in "blurry" forecasts that lack structural fidelity. We introduce (High-Quality Time-Series), a novel framework that bridges the gap between regression accuracy and generative fidelity. HQ-TS employs a two-stage architecture: first, a Hierarchical Query Transformer captures multi-scale temporal dependencies; second, a lightweight Diffusion Refinement module corrects high-frequency artifacts and quantization errors. Extensive experiments on the ETTh2, Weather, and Traffic datasets demonstrate that HQ-TS not only achieves state-of-the-art (SOTA) performance on MSE/MAE metrics but also improves the Visual Turing Test score by 35% compared to standard Transformer and Informer baselines.
